Koch was born in 1841 near Hamburg

. He moved with his family to Milwaukee in 1854. He became a tinner in his father's shop, eventually becoming an executive of the John Pritzlaff Hardware company. He married Pritzlaff's daughter, Elizabeth, in 1864.
Koch received his party's nomination for lieutenant-governor in 1892. He was instead elected mayor of Milwaukee in that year, and was reelected to a second two-year term in 1894. His first term saw the Panic of 1893
